Based on the histograms and Q-Q plots, we find out that
F_columns (F_trans,
F_redem): These variables exhibit right-skewness, as
evidenced by the long right tails in their histograms and the deviations
from the line in their Q-Q plots.
M_columns (M_trans,
M_redem): These variables also show strong right-skewness,
similar to the F_columns.
R_columns (R_trans,
R_redem): These variables appear to be somehow equally
distributed, especially when compared to the F_ and
M_ columns. The Q-Q plots also suggest a somehow closer fit
to a normal distribution.
For F_ and M_ columns: Given their
skewness, we may consider transformations like square
root (\(\sqrt{x}\)) and
logarithm (\(\log{(x+1)}\)) (or
Box-Cox) to make the data look more normally
distributed. After the transformation, we may also apply the Min-Max
normalization or Z-score standardization.
For R_ columns: Since these are distributed
continuously, we don’t need to transform them. Min-Max normalization or
Z-score standardization would be suitable without any
transformations.
For a detailed look-up, we will compare the original, under
square root transformation (\(\sqrt{x}\)), and under logarithm
transformation (\(\log{(x+1)}\)) on histograms of
F_col, M_col, and R_col.

Some normalization typically applied after logarithmic transformation includes:

I hate negative values since they will be less intuitive, so that excludes the use of (1) and (4). Since all data is taken under log transformation before I go to the normalization stage, the use of (3) will not yield negative values. The ranges of (2) and (3) will be \([0, 1]\), so either one will work. However, since Min-Max normalization is more common used, we will go with this one. I will follow an adjusted Min-Max normalization to widen the range from \([0, 1]\) to \([0, 10]\):

To rigorously prove that the transformation is reversible, we need to show that the function is injective (one-to-one) and surjective (onto). In this case, we will focus on proving that the function is injective.
Recall the definition of Injective (One-to-One): A function \(f: A \to B\) is said to be injective if for every \(a, a' \in A\), \(f(a) = f(a')\) implies \(a = a'\).
Let’s first assume we have 2 different normalized and log-transformed values \(\hat{X}_1\) and \(\hat{X}_2\) that map to the same original value \(X\) under the reverse transformation. That is,

Clearly, the exponential function is always injective as every strictly increasing function is injective. Hence, we can conclude that

Further simplifying, we obtain that

Since we assumed that \(\hat{X}_1\) and \(\hat{X}_2\) are different but found that they must be the same, it raises a contradiction. Therefore, our original assumption that two different \(\hat{X}\) values could map to the same \(X\) must be FALSE.
The function is injective (one-to-one), meaning that each \(\hat{X}\) maps to a unique \(X\) under the reverse transformation. Therefore, the function is reversible.
For code implement, I fail to successfully recover the transformed
data back to its original form. It seems numpy works
extremely better here due to numerical stability. In R, I cannot set the
tolerance for some reasons. You can take a look at the recovery
algorithm and recovery check function in Statistical Modeling XI
b - Logarithmic Transformation, Adjusted Min-Max Normalization, and
Reversal Functions.
